Cross-sell (Çapraz satış) Nedir?

Çapraz satış, bir müşterinin satın alma kararı verdiği ürünün yanında bir ürün daha satın almasıdır. Yani, müşteriyi daha fazla harcama yapmaya ikna etmek için kullanılan bir satış tekniğidir. Upsell ise satın alınan bir ürünün daha gelişmiş veya pahalı versiyonunu almaya ikna etmektir. Cross-sell'in Upsell'den farkı, bir müşterinin aldığı ürüne uyumlu ikinci bir ürün satmaktır.

Nasıl Kullanılır?

Amazon, satışlarının %35'ini her ürün sayfasına yerleştirdiği "Bu ürünü satın alanlar bunları da aldı!" şeklindeki çapraz satış uygulamasına borçludur. Çapraz satış, günümüzde karşımıza çıkan popüler pazarlama yöntemlerinden biri olarak kullanılır.

  • Bir elektronik mağazasının dijital kamera satın alan müşterilerine hafıza kartı satmayı denemesi,
  • Bir fast-food restoranında "Menünün yanında soğan halkası da ister misiniz?" diye sorulması,
  • Bir e-ticaret sitesinin ödeme ekranında, popüler olan ürünlerden, ürünü tamamlayıcı bir aksesuarın tanıtımının yapılması

bu pazarlama yöntemine örnek olarak gösterilebilir.

Bir ürünün çok satılması veya birden fazla ürünle satılması durumu alıcıların kişisel özelliklerine, satış yapılan tarihe ve özel günlere bağlıdır. Satış söz konusu olduğunda tüm bu özellikler bütün olarak ele alınmalıdır. Buna bağlı olarak, çapraz satış kararı almak için verilerinizi yorumlayabiliyor olmanız gerekmektedir. İşletmeler bu yorumlamayı veri güvenliklerini düşünerek işletme içerisinde yapmak istediklerinde ciddi bir veri bilimcisi maliyetiyle karşı karşıya kalabilmektedirler. Dolayısıyla, işletmeler uzmanlık alanlarının dışındaki maliyetlere yer ayırmak istemeyebilirler. Günümüzde, popüler olan otomatik makine öğrenme motorları işletmelerin yapay zeka teknolojilerini daha az maliyetle kullanmasını sağlamaktadır.

Veri Kolonları ve Anlamları

InvoiceNo (fatura numarası): Modelde her bir fatura numarası bir sipariş işlemiyle özdeşleşmektedir. Bu da bir fatura numarasının tekrarı anlamına gelebilmektedir. Bu doğrultuda ilgili kolona çapraz satış için bakabileceği anlamına gelmektedir.

StockCode (ürün stok kodu): Her ürün türü için atanmış özel bir stok numarası olduğu için bu numaralar ürünleri ifade etmek için kullanılmaktadır.

Description (ürün açıklamaları): Ürün stok kodunun temsil ettiği ürünü sözel olarak açıklayan kolondur. (Örn; 21730 numarası glass star frosted t-light holder ürününü ifade etmek için kullanılmaktadır.)

Quantity (miktar): Siparişlerde alınan ürünlerin tek seferde kaç tane alındığını gösteren kolondur.

InvoiceDate (sipariş tarihi): Siparişin verildiği tarihi gösteren kolondur.

UnitPrice (birim fiyat): Ürünlerin birim fiyatını gösteren kolondur.

CustomerID (müşteri numarası): Müşterilerin kendilerine özel olan ayırt edici numaralarıdır.

Country (ülke): Müşterilerin hangi ülkelerde yaşadığını gösteren kolondur.

Yukarıdaki kolonlar kullanılan verilerin ham halini içermektedir. Verileri, çapraz satış uygulanabilir hale getirmek için bazı düzenlemeler yapıldı.

Verilerin İşlenmiş Halinin Kolonları ve Anlamları

Value: InvoiceNo değerlerini içeren yeni bir kolon oluşturuldu. Önceki InvoiceNo kolonundan farkı, fatura numaralarının tekrar etmiyor olmasıdır. Her siparişe özel, birlikte alınan ürünleri bir arada görebilmek için bu dizayn oluşturuldu.

InvoiceDate, Description, Quantity kolonlarında aynı şekilde bırakıldı.

UnitPrice (birim fiyat): Aynı faturaya ait ürünleri listelerken, listelenen ürünlerin fiyatlarının farklı olabilmesi için ve karmaşayı engellemek için bu kolon kaldırıldı.

CustomerID (müşteri numarası): Fatura numaralarının tekrarı olmadığında, benzersiz müşteri numaralarına ihtiyaç bulunmamaktadır. Müşteri numaraları her işletmede değişebileceğinden ayırt edici özellik değildi. Bu nedenle kolon kaldırıldı.

Bizim oluşturduğumuz Kolonları İnceleyelim

Verilerimizi InvoiceNo'ya göre grupladığımızda, fatura numarasına bağlı olarak toplu satışlar görülebilmektedir. (örn; 536365 numaralı faturada birlikte satın alınan ürünler 3536, 2794, 3044, 2985, 2984, 1662, 800 şeklindedir.) Gruplandırmaya göre yeni oluşturulan kolon sayısı col4'ten başlayarak col194'te son bulmaktadır. Veriler arasından popüler ürün sıralaması yapıldı. Tek başına veya birlikte satılan en popüler ürünlerin numaraları 3515, 1631, 180, 2733, 3305, 4062 olarak gözlemlendi.

Bu ürün numaralarından birer kolon oluşturuldu. Oluşturulan kolonlar one hot encoding yöntemiyle dolduruldu. Örneğin 3515 için col4'ten col194'e kadar 3515 ürününün geçip geçmediği kontrol edildi. Eğer geçtiyse '1' geçmediyse '0' olarak gruplandırıldı. Aynı işlem diğer beş ürün için de gerçekleştirildi.

Verilerin OptiScorer'da skorlanmak için yapılan veri ön işleme kısmı tamamlandı. Son olarak, veri, Knime kullanılarak %30'u test ve %70'i eğitim dosyası olarak gösterilen şekilde ayrıldı. Verileri ayırmak için, Pandas, Excel de kullanılabilmektedir.

Test dosyasından, satış oranı ölçülmek istenen ürünün kolonu silinmektedir. Bu kolonlar, popüler ürünlerden oluşturulan kolonlara denk gelmektedir. Silinen kolon bilgisayara kaydedildikten sonra, aynı işlemler belirlenen altı ürünün her biri için de yapılmaktadır. Kaydedilen bu dosyalar daha sonra skorları karşılaştırmak için lazım olacaktır.

3515, 1631, 180, 3305, 4062 numaralı ürünler, otomatik makine öğrenme modeli olan OptiScorer kullanılarak skorlanmaktadır.

Eğitim için oluşturulmuş dosyada tahmin edilmek istenen ürünlerin kolonunun son kolona denk geldiğinden emin olunmalıdır. Eğitim ve test verileri OptiScorer'a yüklenmektedir.

Eğitim ve test verisi yüklendikten sonra sağdaki artı butona tıklanmaktadır. Yüklenen analiz sonucunda elde edilen grafikler ve tablolar her ürün için aşağıdaki gibi sıralanmıştır:

4062 numaralı ürün için

X değişkenleri tahmin sonuçlarını etkileyen değişkenleri ifade eder. Özellikle sonucu etkilediği düşünülen, karşılaştırmak istenilen bir değişken varsa, değişkenler arasında seçim yapılabilmektedir.

Pasta grafiğinde de tahmin sonuçlarının aralıkları verilmektedir ve kolay yorumlama için renklendirme yapılmıştır.

Bu histogram, verilerin -0,2 ve 0,2 arasındaki dağılımlarını ifade eder.

İndirilen tahmin sonucuyla test verisini yüklemeden önce silip bilgisayara kaydedilen kolonun karşılaştırması yapılarak OptiScorer'ın başarısı ölçülmektedir.

Doğruluk oranı: %96,674

Bu tahmin sonucuna göre e-ticaret sitesi diğer beş ürünü satın alan müşterilerine 4062 numaralı ürününü önerebilmektedir. 118 önerme arasından 59 müşteri bu ürünü gerçekten satın alanlar arasındadır. Diğer beş ürünü satın almış ama 4062 numaralı ürünü almayacak müşterilerin skorlarını, 2949 müşteriden 2906'sını doğru tahmin ederek geri dönüşü olmayacak pazarlama maliyetinden işletmeleri kurtarmıştır.

1631 numaralı ürün için

Doğruluk oranı: %99,576

Tahminin işletmelere nasıl fayda sağlayabileceğini incelersek; 1631 numaralı ürün, diğer beş ürünün alındığı durumlarda müşterilere önerilebilmektedir. Tabloya göre, 737 ürünün 4'ü satılmayan ürün olarak belirtilmektedir. Bu sonuç, 733 ürünün doğru müşteriyle eşleştiği anlamına gelmektedir. Yani, OptiScorer, 737 üründen 733 tanesinin doğru müşteriyle eşleşeceğini doğru tahmin etmiştir. Tahminin başarılı olması satış artışlarını ifade eder.

3305 numaralı ürün için

Doğruluk oranı: %73,883

Tahminlerin işletmelere nasıl faydalı olabileceği incelendiğinde; 3505 ürünü için, diğer beş ürünü alanlardan 37 tanesi sadece 3505 ürününü ikinci olarak tercih etmiş. Analiz sonucunda OptiScorer bu 37 kişiden 9 kişiyi doğru tahmin etmiştir. Bu sonuç 3505 ürünün diğer beş ürüne kıyasla birlikte satılırken daha az ilgi gördüğünü göstermektedir.

2733 numaralı ürün için

Doğruluk oranı: %67,34

2733 ürünü, diğer beş ürünü alan müşterilere önerildiğinde, 631 satın alımdan, 230 tanesi doğru tahmin edilmektedir. Bu durum, tahminlerimizi paraya dönüştürmede işletmeye satış artışı olarak geri dönmektedir. Yeni bir müşteri kazanmak yerine, eldeki müşteriler satın almak istedikleri ürünlerden daha fazlasını almaya ikna edilmiştir.

180 Numaralı Ürün için

Doğruluk oranı: %93,218

Tahminin işletmelere nasıl faydalı olabileceği incelendiğinde; 180 ürününün, popüler satılan ürünlerden olmasına rağmen çapraz satışa uygun bir ürün olmadığı tespit edilmiştir. Ürünün, birden fazla ürünle satın alma oranı oldukça düşüktür. Diğer ürünlerle kıyaslandığında, çapraz satış oranı en düşük olan ürün olduğu gözlemlenmektedir. Bu durum, işletmeyi sırf popüler bir ürün diye 180 ürününü çapraz satışa koymaktan alıkoymaktadır. Bu da çapraz satışın bilinçli yapılması gerektiğini göstermektedir.

Son olarak, çapraz satışta başarılı çıkan ve müşterilere önerilecek olan ürünleri listelediğimizde; 4062, 1631, 3305, 2733'ün en çok birlikte satılan ürünler olduğuna karar verilmiştir. Bu durumda içlerinden biri alındığında diğerleri çapraz satış için öneri ürünü olarak kullanılmaya uygundur.

Winning a new customer costs your business seven times what it costs to keep an existing one. Analysing customer loyalty correctly and investing in the right customer is always the more profitable path. Forecasting customer lifetime value accurately matters because it is how a business measures what it should expect from its customers. That key concept — CLTV — is the expected total of all the revenue a customer will generate for your business.

What Is Cross-Selling?

Cross-selling is when a customer buys an additional product alongside the one they have already decided to purchase. It is, in other words, a sales technique used to persuade a customer to spend more. Up-selling is persuading someone to buy a more advanced or more expensive version of a product. What distinguishes cross-selling from up-selling is that it sells the customer a second product that complements the one they are buying.

How Is It Used?

Amazon owes 35% of its sales to the cross-sell feature it places on every product page: "Customers who bought this item also bought". Cross-selling is one of the popular marketing methods we encounter today.

  • An electronics store trying to sell a memory card to customers who buy a digital camera,
  • A fast-food restaurant asking, "Would you like onion rings with your meal?",
  • An e-commerce site promoting, on its checkout screen, an accessory from among its popular products that complements the item being bought

are all examples of this marketing method.

Whether a product sells in volume, or sells alongside more than one other product, depends on the personal characteristics of the buyers, on the date of the sale and on special occasions. When it comes to sales, all of these attributes have to be considered as a whole. It follows that you need to be able to interpret your data in order to make a cross-sell decision. When businesses want to do that interpretation in-house for the sake of data security, they can find themselves facing a substantial data scientist bill. Understandably, a business may not want to set aside budget for costs outside its own area of expertise. Today's popular automated machine learning engines let businesses use artificial intelligence technology at lower cost.

What Are the Advantages of Cross-Selling?

1. More Sales: The increase in sales here means something specific — not a rise in overall customer numbers, but customers buying more products in a single transaction.

2. Optimised Costs: Handling one order containing several products is always cheaper than handling several orders each containing one product.

3. Greater Customer Loyalty: Making users feel valued by anticipating their needs increases their attachment to your brand.

4. Knowing Your Audience Better: Customer behaviour can be analysed with every new sale, which makes for a more effective sales strategy.

5. Selling the "Unknown Products": It is an excellent opportunity to put less popular products in front of customers.

6. A Better User Experience: When a second product is offered, the user engages more with the website — an effective way of strengthening your SEO work.

For an e-commerce site that wants to capture the business benefits of cross-selling described above, sales data is analysed in OptiScorer, a scoring engine that works by generating automated machine learning models, to determine which of the business's products should be part of its cross-sell plan.

The Data Columns and What They Mean

InvoiceNo: In the model, each invoice number corresponds to one order transaction, which can mean the same invoice number appears more than once. This is what makes the column relevant to cross-selling.

StockCode: Because every product type is assigned its own stock number, these numbers are used to identify the products.

Description: The column that describes in words the product represented by the stock code. (For example, the number 21730 is used to denote the glass star frosted t-light holder.)

Quantity: The column showing how many units of a product were bought in a single order.

InvoiceDate: The column showing the date on which the order was placed.

UnitPrice: The column showing the unit price of the products.

CustomerID: The distinct number unique to each customer.

Country: The column showing which country the customers live in.

The columns above describe the data in its raw form. Some changes were made to make the data usable for cross-selling.

The Columns of the Processed Data and What They Mean

Value: A new column containing the InvoiceNo values was created. It differs from the original InvoiceNo column in that the invoice numbers do not repeat. This design was chosen so that the products bought together in each individual order can be seen side by side.

The InvoiceDate, Description and Quantity columns were left as they were.

UnitPrice: This column was removed, because when the products belonging to the same invoice are listed the prices of those products can differ, and dropping it avoids the resulting confusion.

CustomerID: Once invoice numbers no longer repeat, unique customer numbers are not needed. Customer numbers were not a distinguishing feature either, since they vary from business to business. The column was therefore removed.

A Look at the Columns We Created

When the data is grouped by InvoiceNo, the bundled sales tied to each invoice number become visible. (For example, the products bought together on invoice 536365 are 3536, 2794, 3044, 2985, 2984, 1662 and 800.) The new columns created by this grouping start at col4 and end at col194. The products were then ranked by popularity. The most popular products, sold either alone or together with others, were found to be numbers 3515, 1631, 180, 2733, 3305 and 4062.

A column was created for each of these product numbers and filled in using one-hot encoding. For 3515, for instance, columns col4 through col194 were checked for the presence of product 3515; where it appeared the value was grouped as '1', and where it did not, as '0'. The same operation was carried out for the other five products.

That completed the preprocessing needed to score the data in OptiScorer. Finally, the data was split using Knime into a test file containing 30% and a training file containing 70%. Pandas or Excel can also be used to split the data.

The column of the product whose sales rate is to be measured is deleted from the test file. These columns are the ones created from the popular products. Once the deleted column has been saved to the computer, the same steps are repeated for each of the six selected products. Those saved files will be needed later to compare the scores.

Products 3515, 1631, 180, 3305 and 4062 are scored using OptiScorer, an automated machine learning model.

In the file created for training, make sure that the column of the product to be predicted is the last column. The training and test data are then uploaded to OptiScorer.

Once the training and test data have been uploaded, the plus button on the right is clicked. The charts and tables produced by the resulting analysis are set out below for each product:

For Product 4062

The X variables are the variables that influence the prediction results. If there is a particular variable you believe influences the outcome and want to compare, you can select among the variables.

The pie chart gives the ranges of the prediction results, colour-coded for easy interpretation.

This histogram shows the distribution of the data between -0.2 and 0.2.

OptiScorer's performance is measured by comparing the downloaded prediction results against the column that was deleted from the test data and saved to the computer before uploading.

Accuracy: 96.674%

On the strength of this prediction, the e-commerce site can recommend product 4062 to customers who buy the other five products. Of 118 recommendations, 59 customers genuinely went on to buy the product. As for the customers who bought the other five products but would not buy product 4062, the model scored 2,906 of 2,949 correctly, sparing the business marketing spend that would never have been recouped.

For Product 1631

Accuracy: 99.576%

Looking at how the prediction can benefit a business: product 1631 can be recommended to customers in cases where the other five products were bought. According to the table, 4 of 737 products are marked as unsold. That result means 733 products were matched with the right customer — in other words, OptiScorer correctly predicted that 733 of 737 products would find the right customer. A successful prediction translates into higher sales.

For Product 3305

Accuracy: 73.883%

Looking at how the predictions can benefit a business: for product 3505, 37 of the customers who bought the other five products chose 3505 as their second product. The analysis shows that OptiScorer predicted 9 of those 37 people correctly. This result indicates that product 3505 attracts less interest as part of a bundle than the other five products do.

For Product 2733

Accuracy: 67.34%

When product 2733 is recommended to customers who buy the other five products, 230 of 631 purchases are predicted correctly. This is how predictions turn into money for the business, coming back as an increase in sales. Rather than winning a new customer, existing customers have been persuaded to buy more than what they came for.

For Product 180

Accuracy: 93.218%

Looking at how the prediction can benefit a business: product 180 turns out not to be a good candidate for cross-selling, despite being one of the popular sellers. Its rate of being purchased alongside other products is very low. Compared with the other products, it has the lowest cross-sell rate of all. That finding stops the business from putting product 180 into a cross-sell simply because it is popular — which shows that cross-selling has to be done deliberately.

Finally, listing the products that performed well in cross-selling and should be recommended to customers, 4062, 1631, 3305 and 2733 were judged the products most often sold together. When any one of them is bought, the others are therefore suitable for use as cross-sell recommendations.
